Real-world metrics matter more than benchmark scores

Without a structured collection and preprocessing system, models inherit noise, bias, duplication, and inconsistency that no amount of fine-tuning can fully correct.

The amount of training data depends on model size and training objective. Small fine-tuned models can be adapted with thousands of examples, while foundation models require trillions of tokens; GPT-3 used approximately 300 billion tokens, and Meta's Llama 3 was trained on over 15 trillion tokens from web, code, and domain-specific sources. A general rule of thumb from Chinchilla scaling research is that optimal training uses roughly 20 tokens per model parameter.

LLMs are trained on data from multiple source types: public web datasets (primarily Common Crawl and derivatives like FineWeb and C4), digitized books and academic papers, code repositories (GitHub), Wikipedia, licensed news and publishing corpora, and increasingly, synthetically generated data. Most foundation models use a weighted mix of these sources, with web data comprising the largest share by volume and curated sources like Wikipedia upweighted for quality.

Web scraping involves actively crawling and extracting text from websites in real time, giving you control over recency and source selection but requiring significant infrastructure and legal compliance work. Public datasets like Common Crawl or FineWeb are pre-collected, pre-processed snapshots that are faster to use but may be months or years old. For most fine-tuning use cases, starting with a public dataset is more efficient; web scraping is most valuable when you need domain-specific, proprietary, or very recent data not available in existing datasets.

The best tool depends on your scale and target websites. Scrapy is the strongest choice for large-scale, multi-site crawling projects requiring custom pipelines. Beautiful Soup is better for smaller, simpler scraping tasks on static HTML pages. Selenium is necessary when target sites use JavaScript rendering or require user interaction (form submission, login). For most LLM data collection projects at scale, Scrapy combined with a rotating proxy service provides the best balance of performance and reliability.

Deduplication is the process of identifying and removing duplicate or near-duplicate documents from a training dataset. It matters because duplicate content causes models to over-represent frequently repeated text, introduces training instability, and wastes compute budget on redundant examples. Research on the CCNet pipeline found that deduplication can reduce raw dataset size by 70% or more. Modern deduplication uses MinHash algorithms combined with Locality Sensitive Hashing (LSH) to efficiently detect near-duplicates across billion-document corpora.

Instruction tuning is a fine-tuning technique that trains a pretrained LLM to follow natural language instructions by exposing it to thousands of instruction-input-output examples. Each training example specifies a task (the instruction), optional context (the input), and the expected response (the output). Instruction tuning datasets can be created through human annotation, synthetic generation using the Self-Instruct technique, or by reformatting existing NLP task datasets. Stanford's Alpaca dataset demonstrated that 52,000 synthetically generated instruction pairs can produce strong instruction-following behavior.

LLM training data quality is ensured through a multi-stage preprocessing pipeline: quality filtering (removing spam, boilerplate, and low-information content using heuristic rules or trained classifiers), deduplication (removing exact and near-duplicate documents using MinHash), PII redaction (removing personally identifiable information using regex and NER models), and tokenization quality checks. Research consistently shows that models trained on filtered, deduplicated data outperform those trained on raw data, even when the filtered dataset is significantly smaller.

Synthetic data generation creates artificial training examples using algorithms or existing AI models, rather than collecting real-world text. For LLM training, synthetic data is most commonly used to supplement fine-tuning datasets when real annotated examples are scarce or expensive. The Self-Instruct technique uses a capable LLM to generate instruction-output pairs from a small set of human-written seed examples. Synthetic data is also used for data augmentation, privacy-preserving training (replacing real PII with synthetic equivalents), and creating balanced datasets for underrepresented domains.
